Door deze microstructuur zorgvuldig te ontwerpen, kunnen deze materialen ongebruikelijke en nuttige eigenschappen vertonen, zoals instelbare stijfheid, een negatieve Poisson-ratio, programmeerbare vormveranderingen en regelbare golfvoortplanting. Een bijzonder krachtig mechanisme achter deze functionaliteiten is knik (buckling). Onder belasting kan een structuur plotseling overschakelen van het ene naar het andere deformatiepatroon, wat leidt tot grote veranderingen in de totale mechanische respons. Dit maakt knik nuttig voor ontwerp, maar ook moeilijk te simuleren en te voorspellen.\n\nDe belangrijkste moeilijkheid die in dit proefschrift wordt aangepakt, is dat de mechanische respons van knikkende metamaterialen niet-lineair is, sterk afhankelijk is van de geometrie en wordt bepaald door symmetrie. Bovendien kan de oplossingsruimte na het knikken multimodaal zijn: een enkele microstructuur onder een vaste belastingstoestand kan verschillende fysiek geldige deformatiepatronen toelaten. Dit is een uitdaging voor zowel machine-learning modellen als conventionele simulaties, omdat de verkregen oplossing kan afhangen van imperfecties of numerieke keuzes. Het verkennen van alle toelaatbare reacties is computationeel duur. Machine-learning surrogate-modellen bieden een sneller alternatief, maar standaardmodellen negeren vaak de fysische structuur, wat leidt tot slechte generalisatie of niet-fysische voorspellingen.\n\nDit proefschrift onderzoekt hoe machine learning kan worden aangepast aan deze context door fysische en geometrische structuren direct in het leerprobleem in te bedden. Het werk is georganiseerd rond vier onderzoeksvragen:\n\n1. Hoe kunnen surrogate-modellen van neurale netwerken worden ontworpen zodat ze de symmetrie\u00ebn en fysische beperkingen respecteren? Er is een gelijkenis-equivariante graaf-neuraal netwerk (SimEGNN) ontwikkeld dat translatie, rotatie, reflectie, schaling en periodiciteit als inductieve biases gebruikt voor fysisch consistente voorspellingen van stijfheid en deformatie.\n\n2. Hoe kan een dataset worden geconstrueerd voor een breed scala aan ontwerpen, inclusief alle periodieke vlakke symmetriegroepen? Dit proefschrift introduceert een dataset van 1.020 microstructuren gebaseerd op de 17 behangpatroongroepen (wallpaper groups), inclusief hun gesimuleerde respons onder grote vervormingen en knik.\n\n3. Hoe kunnen modellen symmetrie-breking representeren waarbij \u00e9\u00e9n input tot meerdere outputs leidt? Dit wordt aangepakt met equivariante 'flow matching'. Deze generatieve methode leert een kansverdeling die de symmetrie\u00ebn van het systeem respecteert, terwijl individuele monsters de symmetrie mogen breken zonder in een niet-fysisch gemiddelde te vervallen.\n\n4. Hoe kunnen deze modellen worden geschaald naar realistische kniktrajecten? Er is een hi\u00ebrarchisch probabilistisch raamwerk ontwikkeld dat equivariante graaf-netwerken combineert met temporele modellering om lokale en globale deformatiepatronen te co\u00f6rdineren.\n\nSamen ontwikkelen de vier delen van dit proefschrift een coherente aanpak voor het leren van het niet-lineaire gedrag van knikkende mechanische metamaterialen. Het resultaat is een equivariant data-gestuurd raamwerk dat snellere simulatie en een systematische behandeling van meerdere mogelijke post-buckling reacties mogelijk maakt.","summary":"Mechanical metamaterials are engineered materials whose mechanical behavior is governed not only by the material they are made from, but also by the geometry of their internal microstructure. By carefully designing this microstructure, these materials can exhibit unusual and useful properties, such as tunable stiffness, negative Poisson\u2019s ratio, programmable shape changes, and controllable wave propagation. A particularly powerful mechanism behind these functionalities is buckling. Under loading, a structure may suddenly switch from one deformation pattern to another, giving rise to large changes in the overall mechanical response. This makes buckling useful for design, but also difficult to simulate and predict.\n\nThe main difficulty addressed in this thesis is that the mechanical response of buckling metamaterials is nonlinear, strongly geometry-dependent, and governed by symmetry. In addition, the post-buckling solution space can be multimodal: a single microstructure under a fixed loading condition may admit several physically valid deformation patterns. This is challenging not only for machine-learning models, but also for conventional finite-element simulations, which can accurately compute individual deformation paths, but do not automatically reveal the full set of possible post-buckling solutions. The solution that is obtained may depend on imperfections, perturbations, or numerical choices. Exploring multiple admissible responses therefore requires repeated simulations or post-processing. This can become computationally prohibitive when many simulations are needed for design, optimization, or uncertainty analysis. Machine-learning surrogate models offer a promising route to faster prediction, but standard deterministic models often ignore important physical structure. They may fail to respect geometric symmetries, generalize poorly to unseen microstructures, or collapse several valid post-buckling solutions into one averaged, nonphysical prediction.\n\nThis thesis investigates how machine learning can be adapted to this setting by embedding physical and geometric structure directly into the learning problem. The work is organized around four research questions.\n\n1. How can neural-network surrogate models be designed so that they respect the symmetries and physical constraints of mechanical metamaterials? To incorporate these symmetries, this thesis develops a similarity-equivariant graph neural network, SimEGNN. The model represents the microstructure as a graph and predicts both effective macroscopic quantities, such as energy, stress, and stiffness, and local deformation fields. Translation, rotation, reflection, scaling, and periodicity are treated as inductive biases that guide the model towards physically consistent predictions.\n\n2. How can a dataset be constructed to study and learn mechanical responses across a broad range of loading conditions and metamaterial designs, including all periodic planar symmetry groups? This thesis introduces a dataset of two-dimensional mechanical metamaterials based on the 17 wallpaper groups. The dataset contains 1,020 microstructures together with their simulated mechanical responses under multiple loading paths in the finite-strain regime, including cases where buckling occurs.\n\n3. How can machine-learning models represent symmetry breaking, where one symmetric input may lead to multiple valid outputs? This challenge is addressed using equivariant flow matching. Flow matching is a generative modeling approach that learns how to transform simple random samples into samples from a target distribution. The learned distribution respects the symmetries of the physical system, while individual samples are still allowed to break those symmetries. This thesis demonstrates that equivariant generative models can represent such symmetry-breaking behavior without collapsing multiple solutions into a nonphysical average.\n\n4. How can equivariant generative models be scaled to realistic buckling trajectories in mechanical metamaterials? The thesis combines equivariant graph neural networks, flow matching, temporal modeling, and a hierarchical architecture into one probabilistic framework. The graph representation captures the geometry, the equivariant architecture preserves symmetries, the generative formulation represents multiple solutions, and the hierarchical structure helps coordinate local and global deformation patterns.\n\nTogether, the four parts of this thesis develop a coherent approach to learning the nonlinear and symmetry-governed behavior of buckling mechanical metamaterials, including cases with multiple admissible post-buckling solutions. The main outcome is an equivariant data-driven framework that enables faster simulation, improved generalization, and a systematic treatment of multiple possible post-buckling responses.","auteur":"Fleur Hendriks","auteur_slug":"fleur-hendriks","publicatiedatum":"13 oktober 2026","taal":"EN","url_flipbook":"https:\/\/ebook.proefschriftmaken.nl\/ebook\/fleurhendriks?iframe=true","url_download_pdf":"https:\/\/ebook.proefschriftmaken.nl\/download\/41583033-825a-4e7a-84fa-ab8a48f1031e\/highres","url_epub":"","ordernummer":"19649","isbn":"978-94-6534-681-6","doi_nummer":"","naam_universiteit":"TU Eindhoven","afbeeldingen":27002,"video_url":"","podcast_url":"","naam_student:":"","binnenwerk":"","universiteit":"TU Eindhoven","cover":"","afwerking":"","cover_afwerking":"","design":""},"_links":{"self":[{"href":"https:\/\/www.proefschriftmaken.nl\/en\/wp-json\/wp\/v2\/us_portfolio\/27001","targetHints":{"allow":["GET"]}}],"collection":[{"href":"https:\/\/www.proefschriftmaken.nl\/en\/wp-json\/wp\/v2\/us_portfolio"}],"about":[{"href":"https:\/\/www.proefschriftmaken.nl\/en\/wp-json\/wp\/v2\/types\/us_portfolio"}],"wp:featuredmedia":[{"embeddable":true,"href":"https:\/\/www.proefschriftmaken.nl\/en\/wp-json\/wp\/v2\/media\/27002"}],"wp:attachment":[{"href":"https:\/\/www.proefschriftmaken.nl\/en\/wp-json\/wp\/v2\/media?parent=27001"}],"wp:term":[{"taxonomy":"university_us_portfolio","embeddable":true,"href":"https:\/\/www.proefschriftmaken.nl\/en\/wp-json\/wp\/v2\/university_us_portfolio?post=27001"}],"curies":[{"name":"wp","href":"https:\/\/api.w.org\/{rel}","templated":true}]}}
